What happens to AI scaling when compute grows faster than the supply of high quality training data?

Classical scaling laws assume labs can keep adding fresh tokens as they increase compute. When fresh data is limited, that additional compute can instead be spent reusing the existing corpus through repeated training or paraphrasing.

To study this researchers introduce Compute-Data scaling laws. The basic idea is to ask how much a repeated or paraphrased token is worth compared with a fresh one.

They tested repetition and paraphrasing on OLMo 3 models from 14M to 600M parameters, using more than 250K H100-hours in total.

Both methods reduced validation loss, which continued to track downstream performance. But the benefit of reused data diminished with each additional batch, especially as model size and fresh data per parameter increased.

The framework helps identify what is limiting a training run. Once reuse reaches diminishing returns, the bottleneck shifts from compute to fresh data and eventually to model capacity.

Additional compute can partly compensate for limited fresh data, but that tradeoff becomes less effective as models and datasets scale.
